Collaborative Analog Circuit Design with Federated AI

TLDR: AnalogFed is a new framework that uses federated learning to enable collaborative design of analog circuits without sharing sensitive proprietary data. It allows multiple organizations to collectively train a powerful generative AI model for discovering new circuit topologies, overcoming data fragmentation and privacy concerns, and achieving high performance comparable to centralized methods.

The world of analog circuit design, a cornerstone of modern electronics, has long faced a significant hurdle: the highly proprietary nature of its data. Designing these intricate circuits involves not only confidential structures but also sensitive information about the commercial semiconductor processes used to build them. This means that valuable design data is often fragmented, locked away in small, private datasets held by individual researchers or institutions. This fragmentation severely limits collaboration and slows down innovation in a field ripe for advancements from artificial intelligence and machine learning.

Addressing this challenge, a groundbreaking new framework called AnalogFed has emerged. AnalogFed is the first scalable and privacy-preserving system designed for analog circuit topology discovery, built upon the principles of federated learning (FedL). Imagine a scenario where multiple entities – be it individual researchers or large institutions – can collectively train a powerful AI model to discover novel analog circuit topologies, all without ever directly sharing their confidential raw data. This is the core promise of AnalogFed.

How AnalogFed Works

At its heart, AnalogFed combines a sophisticated generative AI model with the federated learning paradigm. In a typical federated learning setup, each client (e.g., a company or university) trains a model on its own private dataset. Instead of sending their raw data to a central server, they only send model updates, such as changes in the model’s weights or gradients. The central server then aggregates these updates from all participating clients to create a new, improved global model, which is then sent back to the clients for further local training. This iterative process allows the model to learn from a vast, diverse dataset distributed across many locations, while ensuring that sensitive data remains private and secure.

Innovations for Analog Design

To make federated learning practical for analog circuit design, AnalogFed introduces several tailored techniques. One major innovation lies in its generative AI model, which is specifically optimized for creating analog circuit topologies. This involves a cutting-edge graph modeling approach that represents circuits efficiently. The researchers implemented techniques like node and edge pruning to simplify circuit representations, subgraph mining to identify and reuse common circuit patterns, and an optimized method for converting circuit graphs into sequences for the AI model. These optimizations significantly reduce the complexity and length of the data the model needs to process, making it more efficient and scalable. In fact, these improvements led to an average compression rate of approximately 5.15 times compared to previous methods, meaning the data representation is less than half the original length.

Another crucial aspect is maximizing privacy during deployment. AnalogFed proposes a strategy of federated pre-training followed by decentralized fine-tuning. The generative AI model is first pre-trained across all clients to learn fundamental knowledge about circuit connections across various types. After this collaborative pre-training, each client can then fine-tune the model locally using their own private datasets and proprietary semiconductor technologies. This ensures that while the model benefits from collective intelligence, the specific performance evaluation and customization remain entirely private to each client.

Performance and Robustness

Extensive experiments demonstrate AnalogFed’s impressive capabilities. The generative AI model within AnalogFed achieves a remarkable 95% validity in generating circuits, meaning a high percentage of its designs are functionally correct. It also shows superior scalability, capable of designing circuits with up to 314 devices, and high versatility, supporting 11 different analog circuit types. Furthermore, it excels in novelty, generating nearly 99.6% unique circuits that differ from its training data, indicating a strong capacity for discovering new designs. In terms of performance, measured by a Figure-of-Merit (FoM), AnalogFed consistently outperforms existing centralized methods in tasks like Op-Amp and power converter design.

The framework also proves robust against common security threats in federated learning, such as model and data poisoning attacks. By integrating defense mechanisms, AnalogFed can identify and isolate malicious clients, ensuring the integrity and accuracy of the global model even under adversarial conditions.
