Bridging the Data Gap: Semi-Supervised Preference Optimization for Smarter Language Models

TLDR: Semi-Supervised Preference Optimization (SSPO) is a novel method for aligning large language models (LLMs) with human preferences. It addresses the high cost of data acquisition by learning from a small amount of human-labeled data and a large pool of unlabeled data simultaneously. SSPO achieves this through a principled pseudo-labeling strategy, where it assigns ‘virtual’ preferences to unlabeled data based on a learned reward threshold, and an adaptive scheduler to balance learning from both data types. Experiments demonstrate that SSPO significantly outperforms existing methods, especially with limited human feedback, making LLM alignment more efficient and scalable.

Aligning large language models (LLMs) with human preferences is crucial for ensuring they produce helpful, safe, and ethical outputs. However, current methods for this ‘preference optimization’ heavily rely on vast amounts of human-labeled data, which is incredibly expensive and time-consuming to acquire. This significant bottleneck limits the widespread development of truly aligned LLMs.

A new research paper, Semi-Supervised Preference Optimization with Limited Feedback, introduces an innovative solution called Semi-Supervised Preference Optimization (SSPO). This approach tackles the data scarcity problem by intelligently combining a small set of human-labeled preference data with a large pool of readily available, unlabeled data.

The Challenge of Data Acquisition

Traditional preference optimization methods, like Reinforcement Learning from Human Feedback (RLHF) and Direct Preference Optimization (DPO), require explicit human judgments on which model response is better. This process is labor-intensive, often costing tens of dollars per data point and taking several minutes per comparison. While synthetic data and automatic preference prediction offer some relief, they often struggle with quality assurance and risk propagating existing model biases, failing to capture the subtle nuances of genuine human preferences.

SSPO: A Smart Solution to Data Scarcity

SSPO reframes the problem of preference learning as a probabilistic classification task. The core idea is to learn from both a limited number of explicit human preferences and a large collection of unpaired responses (like those used for supervised fine-tuning) simultaneously. The key innovation lies in its principled pseudo-labeling strategy.

Here’s how it works: SSPO trains a reward function using the small amount of human-labeled data. This reward function learns to assign higher values to preferred responses and lower values to less preferred ones, creating a clear separation in the ‘reward space’. Based on this learned separation, SSPO identifies an ‘optimal reward threshold’. This threshold acts as a decision boundary: any unlabeled response whose reward exceeds this threshold is confidently assigned a ‘winning’ pseudo-label, while those below are assigned a ‘losing’ pseudo-label.

To ensure stability and effectiveness, SSPO employs an adaptive scheduling strategy. This means that during training, the model initially focuses more on the reliable human-labeled data. As the training progresses and the reward function becomes more accurate, the system gradually increases its reliance on the pseudo-labeled, unlabeled data. This curriculum learning approach ensures robust and efficient learning.

Remarkable Data Efficiency and Robustness

Extensive experiments across various datasets and LLM backbones (like Llama3-8B-Instruct, Mistral-7B-Instruct, and Phi-2) validate SSPO’s effectiveness. The results show that SSPO consistently and significantly outperforms existing baseline methods, especially in scenarios where human-labeled data is scarce. For instance, SSPO trained with Llama3-8B-Instruct on just 1% of the UltraFeedback dataset often surpassed strong baselines that were trained on 10% of the same data. This highlights SSPO’s remarkable data efficiency.

Furthermore, SSPO demonstrated robustness to label noise in the paired data and remained effective even with suboptimal assumptions about the prior probability of winning responses in the unlabeled data. Case studies also revealed that SSPO effectively leverages ‘latent preferences’ – implicit quality signals – hidden within the unpaired data, leading to more structured, informative, and context-aware responses.
