TLDR: PiKV is an open-source system designed to efficiently manage the Key-Value (KV) cache in large language models, especially those using Mixture-of-Experts (MoE) architectures. It tackles memory and communication bottlenecks by using expert-sharded storage, intelligent routing, adaptive scheduling, and compression, leading to significant reductions in memory usage and inference latency while maintaining accuracy.
Large Language Models (LLMs) are at the forefront of modern AI, powering everything from virtual assistants to complex reasoning tasks. As these models grow in size and the length of text they can process, a significant challenge arises: managing the Key-Value (KV) cache. This cache stores information from previous tokens, which the model needs to refer back to for generating new text. For very large models, especially those using a Mixture-of-Experts (MoE) architecture, this KV cache can consume vast amounts of memory and slow down the entire process, particularly when running across multiple GPUs or computing nodes.
The MoE architecture, while efficient in computation by activating only a few ‘experts’ for each piece of data, still faces the problem of a dense and globally synchronized KV cache. This means that even if only a small part of the model is active, the entire cache needs to be accessible, leading to bottlenecks in memory and communication.
Introducing PiKV: A Smart Solution for KV Cache Management
A new system called PiKV (Parallel and Distributed KV Cache Serving Framework) has been introduced to specifically address these challenges for MoE architectures. PiKV rethinks how KV caches are managed, transforming them from passive storage into a dynamic, query-driven retrieval system. It aims to make large language model inference more efficient and scalable.
PiKV achieves its goals through four interconnected components:
-
Expert-Sharded KV Storage: Instead of replicating the entire KV cache across all GPUs, PiKV partitions the cache across different GPUs based on the experts. This significantly reduces the memory footprint on each individual GPU.
-
PiKV Routing: This component intelligently decides which experts to activate for each query. It’s ‘cache-aware,’ meaning it prioritizes experts whose relevant KV entries are already readily available, reducing the need for costly cross-device lookups.
-
PiKV Scheduling: This module dynamically manages which KV entries are retained in the cache. Unlike static rules, PiKV Scheduling assigns a ‘utility score’ to each entry based on factors like how recently it was accessed and its potential for future reuse. This ensures that only the most relevant information is kept in fast memory, adapting to the flow of the conversation or text generation.
-
PiKV Compression: To further save memory and bandwidth, PiKV integrates various compression techniques directly into its caching pipeline. This allows for flexible trade-offs between memory usage and the quality of the stored information, using methods like low-rank approximation or multi-resolution clustering.
Significant Performance Gains
The developers of PiKV have conducted extensive experiments, demonstrating impressive improvements. PiKV can achieve up to 3.9 times memory reduction and 1.7 times latency improvement compared to traditional full KV cache approaches. Crucially, it maintains competitive accuracy across various benchmarks, with accuracy drops typically within 1.5% of the full KV cache baseline.
PiKV also shows strong scalability, performing well as sequence lengths increase and across different numbers of GPUs. Its design allows for near-linear scaling with the number of GPUs and sublinear latency growth with sequence length, which is vital for long-context applications.

An Open-Source and Evolving Project
PiKV is publicly available as an open-source software library, inviting contributions and further development from the community. It’s described as a ‘living project’ aiming to become a comprehensive KV Cache management system for MoE architectures. You can find more details about PiKV and its experimental results on its GitHub page: PiKV Research Paper.
By unifying expert routing, cache compression, and stream-aware scheduling, PiKV offers a powerful solution to the memory and communication bottlenecks faced by large, sparsely activated language models, paving the way for more efficient and scalable AI inference.
