Automating Code Lint Error Resolution with LLMs at Scale

TLDR: BitsAI-Fix is an LLM-powered system developed by ByteDance that automates the resolution of lint errors in large codebases. It uses a streamlined workflow for context extraction, patch generation, and validity verification, combined with a progressive reinforcement learning training strategy that adapts from cold-start data to continuous user feedback. Deployed at ByteDance, it has resolved over 12,000 issues with 85% accuracy, significantly reducing developer workload and improving code quality.

In the fast-paced world of software development, maintaining a clean and error-free codebase is crucial. However, as codebases grow in size and complexity, the sheer volume of ‘lint errors’—minor issues like style violations, unused imports, or missing checks—can overwhelm engineers, leading to accumulated technical debt and slowed development. Addressing this challenge, ByteDance has introduced BitsAI-Fix, an innovative system that leverages Large Language Models (LLMs) to automate the resolution of these common code issues.

BitsAI-Fix is designed to streamline the process of fixing lint errors in industrial-scale environments. Unlike more complex, multi-step ‘agent-based’ approaches, BitsAI-Fix employs a lightweight, direct model invocation workflow, making it highly efficient for handling a massive volume of errors. The system works by first extracting relevant code context around an identified lint error, using tools like tree-sitter to pinpoint the minimal necessary code unit and its dependencies. This ensures the LLM receives just enough information without being overloaded.

Once the context is extracted, a specially trained LLM generates a fix in a ‘search-and-replace’ format. This format is robust because it doesn’t rely on specific line numbers, minimizes the amount of code the LLM needs to generate, and is easily applied automatically. Every proposed fix then undergoes an automatic validation process, where the system applies the patch and re-scans the code to confirm the original issue is resolved. If a fix fails validation, BitsAI-Fix can automatically retry generating a solution up to three times.

A core innovation of BitsAI-Fix lies in its progressive reinforcement learning (RL) training strategy. Recognizing that initial ‘cold-start’ scenarios lack real-world ‘golden patches’ (perfect, human-written fixes), the system begins by generating ‘semi-synthetic’ data. This involves creating minimal, compilable code snippets that reproduce the lint errors, allowing the model to learn from execution-based verification (checking if the fix compiles and resolves the issue). As the system is deployed and users accept its suggestions, this valuable ‘user feedback data’ is collected. These accepted fixes serve as high-quality ‘golden patches,’ enabling the RL model to continuously refine its accuracy and generate more precise, non-intrusive modifications through text-matching verification.

The reward mechanism in the RL training is meticulously designed. It not only rewards correct fixes but also penalizes redundant modifications, ensuring the LLM learns to generate concise and focused patches. This emphasis on minimizing unnecessary changes is critical for maintaining code quality and developer acceptance.

Measuring the true impact of an automated fix system can be tricky, as developers often prefer to make changes directly in their local development environments rather than through a web interface. To overcome this, BitsAI-Fix implemented a clever ‘code diff matching’ methodology. Instead of tracking button clicks, the system compares its generated diffs with the actual code changes committed by developers. If the LLM’s suggested fix is fully contained within the developer’s commit, it’s counted as an adoption. This provides a more accurate measure of the system’s real-world effectiveness and helps in continuous model improvement.

In a large-scale deployment at ByteDance, BitsAI-Fix has demonstrated impressive results. The system has supported over 5,000 engineers and automatically resolved more than 12,000 static analysis issues. It boasts an approximate 85% remediation accuracy and sees around 1,000 weekly active adopters. This success highlights the practical feasibility and significant value of LLM-based code remediation solutions in large enterprise settings.

The journey of BitsAI-Fix offers valuable lessons for the industry. It shows that for well-defined problems like lint errors, lightweight LLM solutions can be highly effective and cost-efficient, challenging the notion that all code repair tasks require complex, heavyweight agent frameworks. The progressive training method, adapting from cold-start data to real user feedback, provides a scalable framework for deploying such systems. Furthermore, the innovative evaluation framework, which tracks actual code changes rather than just interface interactions, offers a more reliable way to measure adoption and drive iterative improvements in industrial deployments.
