AgentArcEval: A New Approach to Assessing Foundation Model Agent Design

TLDR: AgentArcEval is a novel architecture evaluation method for foundation model-based AI agents, addressing their unique complexities like autonomous behavior and continuous evolution. It extends traditional evaluation techniques by incorporating agent-specific artifacts and guardrails, and includes a catalog of general scenarios for critical quality attributes. A case study on the Luna tax copilot demonstrated its effectiveness in guiding architectural improvements for accuracy, adaptability, privacy, and other key qualities.

The rapid rise of foundation models (FMs) has paved the way for highly capable and autonomous AI agents, opening up new possibilities across many fields. However, evaluating the underlying architecture of these agents is crucial because architectural choices significantly influence their performance and reliability. Traditional software architecture evaluation methods often fall short when it comes to these advanced agents due to their unique characteristics: they have complex, compound architectures, exhibit autonomous and non-deterministic behavior, and are constantly evolving.

Introducing AgentArcEval: A Tailored Evaluation Method

To address these challenges, researchers have developed AgentArcEval, a novel method specifically designed for evaluating the architecture of FM-based agents. This method builds upon established principles from traditional architecture evaluation techniques, such as the Architecture Tradeoff Analysis Method (ATAM), but incorporates tailored extensions to handle the complexities of modern AI agents.

AgentArcEval focuses on aspects not adequately covered by older methods, like goal-directed autonomy and continuous evolution. It integrates agent-specific artifacts and guardrails into the evaluation process, allowing teams to explicitly reason about common design decisions in FM-based agents. This approach supports early-stage analysis of quality trade-offs through structured, context-specific scenarios, helping stakeholders understand how an architecture will perform under real-world operational demands.

Who Can Use AgentArcEval and When?

AgentArcEval is designed for two primary user groups:

  • Project team architects, who use it to refine their own agent architectures and integrate mechanisms for continuous evaluation.
  • External architecture experts, who conduct independent evaluations for quality assurance and regulatory compliance.

The method can be applied at various stages of a project: early in the design phase, before deployment for a comprehensive review, after deployment to assess real-world performance, and even continuously at runtime for proactive risk management.

The AgentArcEval Process

The evaluation process involves several key steps:

  1. Understanding the agent’s goals and intended capabilities.
  2. Reviewing relevant AI governance regulations, standards, and policies.
  3. Identifying specific quality and guardrail requirements for the agent’s architecture.
  4. Conducting an interactive review of the current agent architecture, including its components, structure, and interactions.
  5. Defining and prioritizing context scenarios based on identified requirements and a provided catalog of agent-specific general scenarios.
  6. Analyzing the agent architecture against these scenarios to identify tradeoffs and risks.
  7. Making recommendations to improve the architecture.
  8. Continuously monitoring and assessing risks during runtime.
  9. Updating and reprioritizing scenarios as the agent evolves.

A Catalog of Agent-Specific Scenarios

A crucial part of AgentArcEval is its catalog of agent-specific general scenarios. These scenarios serve as a structured guide for generating concrete evaluation scenarios, covering critical quality attributes for AI systems. These attributes include accuracy, adaptability, efficiency, privacy, security, fairness, availability, observability, transparency, safety, and contestability. Each scenario is described using a standard template, detailing the source, stimulus, environment, artifact, response, and response measure.

Case Study: The Luna Tax Copilot

The usefulness of AgentArcEval and its scenario catalog was demonstrated through a case study involving the Luna tax copilot, a real-world agent system designed to provide professional and accurate tax recommendations. The evaluation identified seven critical quality attributes for Luna: accuracy, adaptability, efficiency, transparency, observability, contestability, and privacy.

Through the AgentArcEval process, specific context scenarios were defined and prioritized for Luna. The architectural analysis led to several improvements. For instance, to enhance accuracy, a topic classifier and prompt templates were integrated, and a reranker was added to refine search results. To improve adaptability, a memory component was introduced to store user feedback and refine user profiles. Efficiency was boosted by enabling the copilot to retrieve previously answered queries from memory. Transparency was improved by detailing legal sources and the LLM version used in recommendations. Observability was addressed by introducing an AgentOps infrastructure for comprehensive logging. Contestability was enhanced by logging feedback and flagging cases for expert review. Finally, privacy was strengthened by extending guardrails across all components to desensitize sensitive data.

This case study highlights how AgentArcEval effectively guides architectural analysis and decision-making for complex, real-world AI agent systems. For more details, you can read the full research paper here.

Future Outlook

The creators of AgentArcEval aim to establish a community-driven approach to agent system evaluation, planning to publish the method and catalog as a living document to invite contributions from the broader research and development community. This ongoing evolution will ensure the method remains relevant and effective as AI agents continue to advance.
