Agent²: Automating Reinforcement Learning Agent Design with LLMs

TLDR: Agent² is a novel framework that automates the entire reinforcement learning (RL) agent design process using large language models (LLMs). It features a dual-agent architecture (Generator Agent and Target Agent) and a two-stage pipeline: MDP modeling and algorithmic optimization. This system autonomously transforms natural language task descriptions into high-performance RL solutions, consistently outperforming manually designed agents across diverse benchmarks like MuJoCo, MetaDrive, MPE, and SMAC, making RL development more accessible and efficient.

Developing effective reinforcement learning (RL) agents has traditionally been a complex and time-consuming endeavor, demanding significant expertise and often leading to high failure rates. This challenge has limited the widespread adoption of RL in various fields. However, a new framework called Agent² is set to change this by introducing a fully automated approach to RL agent design.

Agent², which stands for ‘Agent-Generates-Agent’, is a novel framework that leverages the power of large language models (LLMs) to automate the entire process of creating high-performance RL agents. It takes natural language task descriptions and environment code as input and autonomously generates comprehensive RL solutions without any human intervention. This breakthrough promises to make RL more accessible and efficient for everyone.

At its core, Agent² features a unique dual-agent architecture. The first is the Generator Agent, which acts as an intelligent AI designer. It analyzes tasks, structures RL knowledge, and generates all the necessary components for an RL agent. The second is the Target Agent, which is the actual RL agent automatically created by the Generator Agent. This Target Agent then interacts with its environment for training and evaluation.

A Two-Stage Approach to Automation

A key innovation of Agent² is its intelligent decomposition of the RL development process into two distinct stages: MDP modeling and algorithmic optimization. This structured approach allows for more targeted and effective agent generation.

Stage 1: MDP Modeling

The first stage focuses on transforming high-level task descriptions into formal Markov Decision Process (MDP) representations. An MDP defines the environment’s dynamics, rewards, and constraints. Agent² uses LLMs to analyze user inputs, including task descriptions and environment code, to identify learning objectives, infer state and action dynamics, and extract constraints. It then refines the observation space, action space, and reward function, which are crucial for how an agent perceives and interacts with its environment. This stage also includes an adaptive verification and refinement framework that continuously checks and improves the generated MDP components through automated validation and feedback, ensuring they are executable and optimized for learning.

Stage 2: Algorithmic Optimization

Once the MDP is designed, Agent² moves to the algorithmic optimization stage. Here, the framework automatically selects the most suitable RL algorithm based on the environment’s characteristics. It then designs the neural network architecture, which is the ‘brain’ of the RL agent, tailored to both the environment and the chosen algorithm. Following this, it optimizes hyperparameters—critical settings like learning rate and discount factor that heavily influence training performance. Finally, all these optimized components are integrated into a unified configuration. This stage also incorporates adaptive refinement, where the system continuously monitors training performance and uses LLMs to incrementally update the configuration for continuous improvement.

Demonstrated Superior Performance

The effectiveness of Agent² has been rigorously tested across a wide range of benchmarks, including single-agent environments like MuJoCo (for continuous control tasks) and MetaDrive (an autonomous driving simulator), as well as multi-agent environments such as MPE (Multi-Agent Particle Environment) and SMAC (StarCraft Multi-Agent Challenge). The results consistently show that Agent² outperforms manually designed solutions across all tasks, achieving significant performance improvements, with some tasks seeing up to a 55% gain.

An ablation analysis further confirmed the complementary impact of both stages. The Task-to-MDP Mapping stage alone improved performance in 83% of scenarios, while the subsequent Algorithmic Optimization stage delivered additional gains in 67% of cases. This highlights how both stages contribute significantly to the overall success of the framework.

By enabling truly end-to-end, closed-loop automation, Agent² establishes a new paradigm where intelligent agents can design and optimize other agents. This marks a fundamental breakthrough for automated AI systems, making advanced reinforcement learning more accessible and efficient than ever before.
