Advancing Spiking Neural Networks with Single-Timestep Processing and Adaptive Optimization

TLDR: A new Spiking Neural Network (SNN) called SDSNN is introduced, which operates in a single timestep to drastically reduce inference latency and energy consumption. It features a novel “Self-Dropping Neuron” that enhances information-carrying capacity and simplifies gradient calculations, alongside a three-stage Bayesian optimization method to automatically find optimal time parameters for each network layer. Experimental results on Fashion-MNIST, CIFAR-10, and CIFAR-100 datasets demonstrate that SDSNN achieves comparable or superior accuracy while significantly cutting energy consumption (up to 56%) and memory usage compared to traditional multi-timestep SNNs.

Spiking Neural Networks (SNNs) are a fascinating area of artificial intelligence, drawing inspiration from the human brain’s event-driven information processing. Unlike traditional Artificial Neural Networks (ANNs) that use continuous signals, SNNs communicate through discrete ‘spikes,’ which offers significant advantages in energy efficiency due to their sparse encoding. This makes them highly promising for applications where power consumption is critical, such as in edge computing devices.

However, a major hurdle for SNNs has been their reliance on multi-timestep computation. This means that information processing often requires several sequential steps, leading to increased inference latency and higher energy use. This limitation has restricted their widespread adoption, especially in scenarios demanding real-time responses.

A recent research paper, SDSNN: A Single-Timestep Spiking Neural Network with Self-Dropping Neuron and Bayesian Optimization, introduces a novel approach to overcome this challenge. The authors, Changqing Xu, Buxuan Song, Yi Liu, Xinfang Liao, Wenbin Zheng, and Yintang Yang, propose a single-timestep SNN designed to enhance accuracy and reduce computational energy consumption within a single processing step.

The Self-Dropping Neuron: A Smarter Spike

At the heart of this new SNN is a cleverly designed mechanism called the Self-Dropping Neuron. Traditional spiking neurons often generate redundant spike sequences, especially as network complexity grows. This can lead to neurons processing too much information or even falling into incorrect states. The Self-Dropping Neuron addresses this by optimizing spike generation through dynamic threshold adjustment and selective spike suppression. Instead of simply firing when a membrane potential exceeds a threshold, this neuron triggers a spike only when the potential exceeds an initial threshold and then begins to decay. This unique approach aims to increase the information carried by each individual spike, making the communication more efficient and reducing unnecessary computations.

Furthermore, the Self-Dropping Neuron simplifies the backpropagation process, which is crucial for training neural networks. It calculates gradients only on the spikes in the final timestep of the forward propagation, eliminating the complex time-domain gradient computations found in traditional multi-timestep methods. This significantly reduces computational overhead during training.

Bayesian Optimization for Precision Tuning

Another key innovation in the SDSNN is the use of Bayesian optimization to automatically tune time parameters. In SNNs, the number of timesteps is a critical hyperparameter that profoundly impacts performance. Too few steps can degrade accuracy, while too many lead to redundant computations. Instead of fixed or heuristically chosen timesteps, Bayesian optimization intelligently searches for the optimal time parameter combination for each layer of the network.

The paper outlines a three-stage Bayesian search method. The first stage globally filters promising timesteps. The second stage refines the selection of timesteps between different spiking layers within a shorter training period. Finally, the third stage further optimizes recognition accuracy over the entire training process. This staged approach allows for a more precise search, faster convergence, and higher accuracy by accounting for how information is distributed across different training periods.

Performance and Efficiency Gains

The SDSNN was rigorously tested on standard image classification datasets, including Fashion-MNIST, CIFAR-10, and CIFAR-100. The experimental results are compelling. Compared to traditional multi-timestep SNNs using the Leaky Integrate-and-Fire (LIF) model, the SDSNN achieved comparable or even superior classification accuracies with only single-timestep spikes. For instance, on Fashion-MNIST, it achieved 93.72% accuracy, on CIFAR-10, 92.20%, and on CIFAR-100, 69.45%.

Beyond accuracy, the energy efficiency improvements are substantial. The SDSNN reduced energy consumption by 56% on Fashion-MNIST, 21% on CIFAR-10, and 22% on CIFAR-100. This significant reduction is attributed to the single-timestep operation, which involves less computational overhead compared to multi-timestep networks. Additionally, the proposed single-timestep SNN demonstrated a notable reduction in memory usage during training, consuming only 0.91GB on CIFAR-10, a significant improvement over methods requiring storage of membrane potentials across multiple timesteps.

In conclusion, the SDSNN represents a significant step forward for Spiking Neural Networks. By introducing the Self-Dropping Neuron and leveraging Bayesian optimization for time parameter tuning, this research effectively addresses the long-standing challenges of latency and energy consumption in SNNs, paving the way for their broader application in energy-efficient computing.
