Advancing Discrete Diffusion Models for Language with Improved Perplexity and Training Efficiency

TLDR: This paper introduces new theoretical bounds for perplexity in discrete diffusion language models, offering a more efficient and tighter evaluation method. It proposes “roulette diffusion,” a novel transition-rate matrix enabling token correction. Crucially, the research demonstrates that training discrete diffusion models using denoising cross-entropy (CEDD) significantly outperforms traditional score-entropy (SEDD) methods, leading to lower perplexity and faster training times in language modeling tasks.

Recent advancements in artificial intelligence have seen continuous diffusion models excel in handling continuous data, but their application to categorical data, such as language, has faced limitations. Autoregressive models have traditionally held an advantage in language modeling. However, new research is pushing the boundaries of discrete diffusion models, offering promising alternatives with unique benefits like non-sequential infilling and potential for faster generation of long sequences.

A significant challenge in evaluating discrete diffusion models has been the complexity of calculating perplexity, a key metric for language models. While previous attempts offered bounds, they lacked guarantees of tightness. A new paper, “Efficient Perplexity Bound and Ratio Matching in Discrete Diffusion Language Models”, addresses this by introducing three new theorems concerning the Kullback-Leibler (KL) divergence between data and learned distributions within the continuous-time discrete Markov chain (CTMC) framework. These theorems provide a discrete counterpart to established continuous diffusion theories.

One of the core contributions is Theorem 4, which offers an improved upper bound for perplexity, referred to as J2. This new bound is not only more computationally efficient but also empirically shown to be tighter than existing methods. This advancement simplifies the evaluation of discrete diffusion models, making it more practical for researchers and developers.

Beyond theoretical improvements, the paper explores practical training methodologies. It empirically demonstrates that a ratio-matching approach, achieved by minimizing denoising cross-entropy between clean and corrupted data, significantly outperforms models that rely on score-entropy. This new strategy, termed Cross-Entropy Discrete Diffusion (CEDD), leads to up to 10% lower perplexity and generative-perplexity, alongside a notable 15% reduction in training steps. CEDD’s advantage lies in its focus on learning mixing weights, which are essential for generation, rather than directly modeling complex conditional ratios.

The research also introduces a novel CTMC transition-rate matrix called “roulette diffusion.” This new matrix allows for prediction refinement, meaning tokens can be corrected even after they are unmasked in the reverse process. This capability is particularly beneficial for tasks like spelling correction, where refining individual tokens is crucial. The paper provides the analytic expression for its matrix exponential, facilitating efficient training and generation.

Experimental results across various datasets confirm that CEDD, especially its variant CEDD*, consistently outperforms the traditional score-entropy-based models (SEDD and SEDDs) across absorb, uniform, and roulette diffusion dynamics. The models trained with CEDD/CEDD* also demonstrate faster convergence to optimal performance and quicker sequence generation. The tighter perplexity bound (J2) further validates the effectiveness of the proposed methods.
