Adaptive Reset Neuron Enhances Spiking Neural Network Performance and Efficiency

TLDR: A new neuron model called AR-LIF (Adaptive Reset Leaky-Integrate and Fire) has been developed for Spiking Neural Networks (SNNs). It introduces an adaptive reset mechanism and a dynamic threshold adjustment, addressing issues of information loss and over-activation in existing SNN neurons. AR-LIF achieves state-of-the-art performance on various datasets while maintaining low energy consumption, making SNNs more efficient and effective.

Spiking Neural Networks (SNNs) are gaining significant attention in the field of artificial intelligence due to their remarkable energy efficiency, a characteristic stemming from their event-driven nature. Unlike traditional Artificial Neural Networks (ANNs) that process information continuously, SNNs operate by transmitting discrete “spikes,” mimicking the way biological brains communicate. This unique approach promises a future of more power-efficient AI systems.

However, a critical challenge in SNNs lies in how individual neurons “reset” after firing a spike. Existing methods, such as “hard reset” and “soft reset,” have notable drawbacks. Hard reset, which simply resets a neuron’s internal state to zero after it fires, can lead to a significant loss of valuable information. On the other hand, soft reset, while retaining some information, often causes neurons to become overly active, leading to inefficiencies and a lack of individual adaptability among neurons.

Addressing these limitations, researchers Zeyu Huang, Wei Meng, Quan Liu, Kun Chen, and Li Ma from the School of Information Engineering, Wuhan University of Technology, have introduced a novel solution: the Adaptive Reset Leaky-Integrate and Fire (AR-LIF) neuron. This new neuron model is designed to overcome the shortcomings of conventional reset mechanisms by introducing an intelligent, adaptive approach.

The core innovation of AR-LIF lies in its ability to establish a dynamic relationship between a neuron’s input, its output spikes, and its reset behavior. Instead of a uniform reset, AR-LIF adapts its reset voltage based on the neuron’s current input and its history of activity. It incorporates an “adaptive decay of input accumulations” mechanism, where a memory variable tracks input over time, and a “spike feedback calculation” that adjusts this accumulation based on whether a spike was fired. This allows the neuron to retain relevant information while preventing excessive activation.

Furthermore, AR-LIF integrates a clever “threshold adjustment strategy.” The threshold, which determines when a neuron fires, is not fixed but adaptively changes based on the input. This dynamic threshold, combined with the adaptive reset voltage, ensures that neurons behave more realistically and efficiently, reflecting the heterogeneity observed in biological neurons.

The impact of AR-LIF is evident in its performance. Tested across various datasets, including common static image datasets like CIFAR10, CIFAR100, and Tiny ImageNet, as well as neuromorphic datasets such as CIFAR10DVS and DVSGesture, AR-LIF has demonstrated impressive accuracy. Notably, it achieved state-of-the-art results on CIFAR100, Tiny ImageNet, and CIFAR10DVS, showcasing its robustness and effectiveness across different types of data.

Crucially, AR-LIF maintains the inherent advantage of SNNs: low energy consumption. Despite its enhanced performance, the model exhibits a lower average spike firing rate, indicating that it achieves superior results without sacrificing the energy efficiency that makes SNNs so appealing for future computing paradigms.
