A New Approach to One-Step Image Super-Resolution: Balancing Detail and Realism

TLDR: Realism Controlled One-step Diffusion (RCOD) is a novel framework for real-world image super-resolution that addresses the challenge of balancing image fidelity and realism in efficient one-step diffusion models. It introduces a latent domain grouping strategy for flexible control over detail preservation versus generative enhancement, a degradation-aware sampling strategy for improved distillation, and a visual prompt injection module that replaces text prompts with visual tokens for better accuracy and semantic consistency. RCOD achieves superior performance in both quantitative metrics and visual quality while maintaining computational efficiency, offering adaptable realism control during inference.

In the rapidly evolving field of artificial intelligence, enhancing image quality remains a significant challenge, especially when dealing with real-world low-resolution images that suffer from complex and unknown degradations. This task, known as Real-World Image Super-Resolution (Real-ISR), aims to reconstruct high-resolution images from their lower-quality counterparts.

Traditional multi-step diffusion models have shown remarkable success in Real-ISR, producing impressive high-resolution reconstructions. However, their iterative nature makes them computationally intensive and impractical for real-time applications. To address this, one-step diffusion (OSD) methods emerged, significantly boosting efficiency by distilling the multi-step process into a single inference step.

Despite their efficiency, existing one-step diffusion models face a fundamental limitation: they struggle to balance image fidelity (how accurate the reconstruction is to the original high-resolution image) and realism (how perceptually pleasing and natural the image appears). This is because most OSD methods are trained or distilled using a single timestep, leading to a fixed output that can’t adapt to diverse scenarios where different levels of fidelity or realism might be desired. Multi-step methods, in contrast, can adjust this balance by varying the number of sampling steps.

Introducing Realism Controlled One-step Diffusion (RCOD)

A new research paper, titled Realism Control One-step Diffusion for Real-World Image Super-Resolution, proposes an innovative framework called Realism Controlled One-step Diffusion (RCOD) to overcome this dilemma. Developed by Zongliang Wu, Siming Zheng, Peng-Tao Jiang, and Xin Yuan from Zhejiang University, Westlake University, and vivo Mobile Communication Co., Ltd, RCOD introduces a flexible control mechanism for balancing fidelity and realism within a single-step diffusion process.

The core of RCOD lies in several key innovations:

  • Latent Domain Grouping (LDG): This strategy modifies the noise prediction phase by grouping training data based on a ‘latent metric’ that perceives the degradation level of low-resolution features. By doing so, the denoising network learns to generate different degrees of detail and realism according to a chosen timestep. During inference, users can easily select a timestep to control the realism level, which increases monotonically with the timestep value.

  • Degradation-Aware Sampling (DAS): To further enhance control and integrate the distillation process with the latent domain grouping, DAS redefines how timesteps are sampled in the pre-trained model. This adaptive alignment provides explicit control over the regularization strength during distillation.

  • Visual Prompt Injection Module (VPIM): Recognizing the limitations and computational burden of traditional text prompts, RCOD replaces them with degradation-aware visual tokens. This module uses a CLIP vision model and an MLP layer, taking the low-resolution image directly as input. This approach eliminates the need for vision-language models, reduces computational overhead, and provides image-specific semantic information, leading to improvements in both fidelity and realism.

The RCOD framework can be easily integrated into existing one-step diffusion methods for Real-ISR, enhancing their capabilities without requiring significant modifications to the training paradigm or additional training data. The authors demonstrated RCOD’s effectiveness by applying it to two state-of-the-art OSD methods, OSEDiff and S3Diff, naming the enhanced versions RCODO and RCODS respectively.

Superior Performance and Efficiency

Extensive experiments show that RCOD significantly outperforms existing one-step diffusion methods in both quantitative metrics (like PSNR, SSIM for fidelity, and MANIQA, MUSIQ for perceptual quality) and visual quality. For instance, the ‘Fidelity’ versions of RCOD (using a lower timestep) achieve better fidelity metrics, while the ‘Realism’ versions (using a higher timestep) yield superior perceptual quality. The ‘Neutral’ versions fall in between, showcasing the framework’s flexible control.

Crucially, RCOD maintains computational efficiency, with similar inference times and trainable parameters as the original methods. In some cases, RCODO even inferences faster due to the removal of the text extractor. This makes RCOD a promising solution for diverse real-world image super-resolution scenarios where dynamic control over image realism is essential.

The code for RCOD will be released, allowing researchers and developers to further explore and implement this innovative approach to image super-resolution.
