Enhancing Data Privacy with LLMs: A New Framework for Synthetic Text Rewriting

TLDR: This research introduces the STYLE-MST Rewriter, a reinforcement learning framework that fine-tunes large language models (LLMs) to generate privacy-preserving synthetic text. It addresses both explicit (PII) and implicit (writing style) privacy threats by using a composite reward function that balances privacy, semantic fidelity, and output diversity. Empirical results show it significantly reduces author re-identification and PII leakage while maintaining text meaning and utility.

In the age of artificial intelligence, the demand for vast, high-quality datasets is ever-increasing. These datasets, often derived from user-generated content, are crucial for training sophisticated machine learning models. However, this reliance on rich data brings significant privacy concerns, as sensitive personal information is inherently embedded within it. While basic anonymization techniques can remove obvious identifiers, they often fall short against more advanced attacks that infer implicit details like writing style, topical focus, or demographic cues.

Addressing this complex challenge of balancing user privacy with data utility, a new research paper introduces a novel approach: the STYLE-MST Rewriter. This framework utilizes reinforcement learning to fine-tune a large language model (LLM), guiding it to generate synthetic text rewrites that protect privacy without sacrificing the original meaning or usefulness of the data. The core idea is to create text that is semantically faithful but stylistically altered, making it much harder to trace back to the original author.

The researchers, Zhan Shi, Yefeng Yuan, Yuhong Liu, Liang Cheng, and Yi Fang, from Santa Clara University and eBay, propose a system that optimizes for multiple factors simultaneously: explicit privacy (removing direct identifiers), implicit privacy (obfuscating subtle cues), semantic fidelity (keeping the meaning intact), and output diversity. This is achieved through a composite reward function that encourages the LLM to learn how to rewrite text effectively. For more technical details, you can read the full paper here.

How It Works: A Multi-Layered Approach to Privacy

The STYLE-MST Rewriter operates through several interconnected components:

Context-Aware Prompt Construction: Before rewriting, the system analyzes the input text to identify explicit Personally Identifiable Information (PII) and assess its unique writing style. If the text has a very distinctive style (flagged as an “outlier”), the system instructs the LLM to adopt a more neutral tone. Otherwise, it allows for more stylistic diversity, ensuring the rewritten text doesn’t become bland.

Style Context Pool: This acts as a dynamic memory, storing stylistic information from previously generated texts. It helps the system understand typical writing patterns and identify unusual ones. A key part of this is the STYLE-MST (Minimum Spanning Tree) module, which maps out global style relationships, ensuring that new rewrites contribute to overall stylistic coverage and avoid creating new, easily identifiable patterns.

Reinforcement Learning Training Loop: The heart of the system is an LLM (specifically, a LLaMA-3.2B model with LoRA adapters) that is fine-tuned using a reinforcement learning technique called Group Relative Policy Optimization (GRPO). The model generates multiple rewrite candidates for each input, and a sophisticated reward function evaluates them. This function considers five key aspects:

  • Semantic Fidelity: How well the rewritten text preserves the original meaning.
  • Length Consistency: Ensuring the rewritten text doesn’t drastically change in length.
  • Format Compliance: Adhering to structural rules.
  • Entity Value Matching: Penalizing any explicit PII that remains in the rewritten text.
  • Style-Aware Privacy-Diversity Tradeoff: This is where the STYLE-MST comes in, guiding the model to either neutralize unique styles (for outliers) or promote diversity (for typical styles), effectively protecting implicit privacy.

Reasoning Process Integration: To make the process transparent and improve training, the LLM is prompted to generate a “chain-of-thought” explaining its decisions. This includes listing detected PII, inferred author attributes, and planned transformations. While this reasoning isn’t shown to the end-user, it helps the model learn more effectively and provides insights into its privacy-preserving strategies.

Demonstrated Effectiveness

The research paper presents compelling empirical results across various datasets (Yelp, Twitter, IMDb). The STYLE-MST Rewriter significantly enhances author obfuscation and other privacy metrics without degrading the semantic quality of the text. For instance, it achieved the lowest “Entity Match” scores, indicating strong suppression of explicit PII, and substantially reduced the ability to re-identify authors or gender from the rewritten text. Importantly, it maintained strong utility, with sentiment classification scores remaining competitive, proving that the essential message and emotional tone are preserved.

Qualitative analysis, including visualizations of author style embeddings, further supports these findings. Before rewriting, author-specific clusters are clearly visible, indicating high re-identification risk. After rewriting, these clusters disperse and intermix, demonstrating successful stylistic anonymization. This shows the model doesn’t just redact words; it re-embeds the text into a safer, anonymized stylistic space.

This work represents a significant step forward in creating scalable and model-agnostic solutions for privacy-preserving data generation, crucial for the continued development of large language models in a privacy-conscious world.
