Optimizing Vision-Language Model Training with Attention-Guided Data Selection

TLDR: ∆-AttnMask is a new framework that efficiently selects and augments data for Vision-Language Models (VLMs). It quantifies data quality by measuring the loss difference when high-attention hidden states are masked. This method achieves state-of-the-art performance with only 20% of the data, accelerating VLM training by 5x and improving accuracy by over 10% compared to full datasets, without needing extra models or training. It also doubles as a data augmentation tool.

In the rapidly evolving field of artificial intelligence, Vision-Language Models (VLMs) have emerged as powerful tools capable of understanding both visual and textual information. These models are crucial for applications ranging from visual question answering to scientific discovery. However, a significant challenge in their development, particularly during the post-training phase known as Visual Instruction Finetuning (VIF), is the immense amount of high-quality, multimodal data required.

Unlike traditional language models that primarily need text data, VLMs demand data that effectively combines images and text, ensuring both content quality and their alignment. This requirement leads to stricter data selection challenges: how to efficiently handle large data demands while maintaining high quality and proper alignment between visual and textual components. Despite its critical impact on performance, data selection for VIF has remained an area needing more attention.

Addressing these limitations, researchers have introduced a novel framework called ∆-AttnMask. This innovative method offers a data-efficient approach to quantify the quality of data samples. It does so by using an attention-guided masking technique on the model’s hidden states, allowing for a joint evaluation of image-text pairs. What makes ∆-AttnMask particularly appealing is that it doesn’t require domain labels, auxiliary models, or any extra training steps.

The core idea behind ∆-AttnMask is quite intuitive: it assesses sample quality by computing the difference in loss between the original model states and states that have been masked using regions of high attention. Essentially, if masking a critical part of the input significantly increases the model’s prediction error (loss), it indicates that the original sample contained valuable and informative content. This “loss difference” (∆) serves as an intrinsic measure of sample quality.

Extensive experiments conducted across various VLMs and datasets have showcased the remarkable effectiveness of ∆-AttnMask. The framework achieved state-of-the-art performance using just 20% of the data, leading to a five-fold acceleration in training time. Furthermore, it surpassed full-dataset baselines by a notable 10.1% in overall accuracy. Its design is both model-agnostic and data-agnostic, ensuring its broad applicability across different modalities and model architectures.

Beyond just data selection, ∆-AttnMask also demonstrates potential in data augmentation. By reusing a high-quality 20% subset of data and applying model-guided perturbations (masking high-attention regions), the method can further enhance data effectiveness. This approach proved superior to simply training on twice the amount of raw data, highlighting its ability to introduce meaningful semantic noise that improves robustness and generalization.
