Knowledge Graphs Unlock Advanced API Calling for Large Language Models in Specialized Domains

TLDR: The KG2data system proposes an innovative approach to enhance Large Language Models (LLMs) for API calls in knowledge-intensive fields like meteorology. By integrating domain-specific knowledge graphs, LLMs, and ReAct agents, KG2data overcomes the limitations of traditional LLM-based API calls and RAG-based systems, which often struggle with domain-specific knowledge gaps, complex queries, and data integration. Experimental results show KG2data significantly improves API call accuracy and reduces failure rates compared to baseline methods, demonstrating the power of combining structured knowledge with advanced AI for intelligent data acquisition and analysis.

Large Language Models (LLMs) have shown impressive capabilities in understanding and generating human-like text. A cutting-edge application of LLMs involves enabling them to make API (Application Programming Interface) calls, allowing them to interact with external tools and systems for data analysis and task execution. However, a significant challenge arises when LLMs are applied to knowledge-intensive sectors, such as the meteorological industry. In these specialized domains, LLMs often struggle due to a lack of specific domain knowledge, leading to difficulties in understanding complex queries, generating accurate responses, and efficiently utilizing tools through API calls.

Traditional methods for handling large-scale meteorological data have faced several limitations. The data is highly diverse and complex, making it difficult to process and analyze efficiently. Issues like data confidentiality and the challenge of valuing meteorological data further complicate its utilization. Moreover, retrieving specific data for multi-industry applications remains difficult for non-expert users, as the data is often more suited for professionals with specialized knowledge.

Previous attempts to enhance LLM capabilities for data analysis include systems like RAG2data. This platform uses Retrieval-Augmented Generation (RAG) techniques and vector databases to manage unstructured data. While RAG2data helps mitigate issues like hallucinations and high inference costs, it has its own set of limitations. These include limited retrieval coverage, difficulty in uncovering deep semantic relationships, challenges in integrating heterogeneous data, inability to perform complex queries or domain-specific reasoning, and delays in data updates.

To overcome these challenges, a new system called KG2data has been proposed. This innovative framework integrates knowledge graphs, LLMs, ReAct agents, and tool usage technologies to perform intelligent data acquisition and query handling, particularly in the meteorological domain. The core idea behind KG2data is to leverage knowledge graphs as a long-term memory module for the LLM. A knowledge graph provides a structured framework for representing knowledge relationships, allowing for the integration of diverse datasets, deep semantic relationship mining, and knowledge reasoning within specialized domains. This structured approach helps LLMs better understand user intentions, even with implicit or lengthy queries, and significantly improves content retrieval coverage.

The KG2data system comprises four key components: a meteorological knowledge graph, a ReAct-expert agent, a Large Language Model, and a calling tool. The meteorological knowledge graph is a multi-dimensional, multi-layered dataset that integrates both unstructured textual descriptions (like heavy rainfall events) and structured data (like precipitation levels). This graph is constructed using LLMs for entity recognition and relationship extraction, and it is optimized with expert knowledge. The ReAct-expert agent, built upon this enhanced knowledge graph, is responsible for retrieving meteorological data and documents from APIs, processing them, and evaluating outcomes for accuracy. It uses the ReAct framework, which interleaves reasoning and action steps, allowing the LLM to generate action plans and interact with external sources for more reliable responses. The data acquisition tools connect APIs with the ReAct expert agents, enabling data collection and analysis based on specific meteorological scenarios.

Experimental evaluations compared KG2data with RAG2data and Chat2data (a baseline without a knowledge graph). The results demonstrated that KG2data significantly outperforms both baseline systems across various metrics. For instance, KG2data achieved an API-calls accuracy rate (ACAR) of 88.57%, compared to RAG2data’s 72.14% and Chat2data’s 71.43%. It also showed remarkably lower failure rates in name recognition, hallucination recognition, and parameter recognition. This superior performance is attributed to the knowledge graph’s ability to provide precise, domain-specific knowledge, enabling the LLM to effectively identify key information and mitigate errors caused by hallucinations.

In essence, KG2data offers a fresh perspective for intelligent knowledge-based question answering and data analysis in knowledge-intensive industries. By combining the reasoning and semantic understanding capabilities of LLMs with the structured, domain-specific knowledge and reasoning power of knowledge graphs, and the precise execution of ReAct agents, the system significantly enhances the performance of LLMs in specialized API applications. This approach also addresses the high computational costs associated with training or fine-tuning LLMs, making it more adaptable to the dynamic nature of domain knowledge and APIs.
